Trace → Dataset Materializer
Overview
This guide covers Trace Collection → Reward Labeling. It exports approved Langfuse generations as redacted Parquet candidates and attaches Ragas and LLM-judge scores. The output is a scored-trace candidate dataset, not ready-to-use GRPO/DPO training input.
The reviewed API references are Langfuse v3.0.0 observations API v1, Airflow 3.1.0/Amazon provider 9.16.0, Ragas 0.3.9, OpenAI Python 1.109.1, langchain-openai 0.3.33, KServe 0.16.0, KEDA 2.18 and vLLM 0.23.0. These identify contracts, not an installed or tested compatibility matrix. Lock dependencies for the maintained deployment and verify the static and operational prerequisites below. No service deployment, inference API call or data upload was executed for this document review.
Langfuse OTel → S3 Parquet
Application instrumentation produces OTel traces/generations. A vLLM request or server metric alone does not automatically produce a complete Langfuse trace. Langfuse v3 stores traces/observations in ClickHouse and separate transactional data in PostgreSQL. The adapter below uses the authenticated public observations API rather than an assumed internal database schema.
Figure 1. Processing flow from Langfuse OTel traces to S3 Parquet training data
Langfuse Trace Schema
The JSON fields id, traceId, type, startTime, endTime, model and metadata come from the API response. This pipeline defines metadata.training_sample; it is not a built-in Langfuse consent or RAG schema. A trusted preprocessing stage supplies redacted question/answer/context fields and an independently reviewed reference. The source model comes from the generation observation, not an invented trace-table column.

],
"reference": "Require current approval and match the approved redacted sample hash.",
"redaction_version": "redactor-v1",

}
}
}
A separate access-controlled approval process supplies approval.json below. sample_sha256 hashes user_input, response, reference and retrieved_contexts using the canonical() function below. The example grant is not real user consent. A caller-provided consent=true field or training-eligible tag cannot authorize training.

An approval list and content hash bind the approved sample; they do not prove redaction or GDPR/CCPA compliance. The exporter excludes raw input/output, unrestricted metadata and user/session IDs. Selected fields still require privacy review, and a reference must not be replaced by the answer being evaluated. observation_id/trace_id remain restricted lineage identifiers for revocation/deletion.
S3 Partitioning Strategy
Each completed run has its own snapshot. date is the generation's UTC start date; model_key is the SHA-256 of its model name. Model names and personal data are not interpolated directly into S3 paths.
s3://<training-bucket>/trace-candidates/<dataset-sha256>/
├── data/date=2026-09-18/model_key=<model-sha256>/part-00000.parquet
└── manifest.json
Partitioning Reasons:
- Date/model: Bound queries and distinguish the source model.
- Snapshot: Retries with identical input, approval and interval use the same path. A manifest is written after all data files; consumers read only its explicitly listed objects. This is neither a multi-object transaction nor snapshot isolation over a changing export API.
- Approval lifetime: Unapproved data is not retained in a
consent=falsetraining partition. Approval is rechecked before export, evaluation and output. A separate lifecycle procedure must propagate later revocations to S3 objects/versions, Glue partitions, candidate data and derived training artifacts.
Apache Iceberg vs Hudi
Table 1. Feature comparison of Apache Iceberg and Apache Hudi
| Feature | Apache Iceberg | Apache Hudi |
|---|---|---|
| Transaction boundary | Table snapshots committed by a catalog and writer | Writer/timeline commits and concurrency configuration |
| Schema evolution | Explicit supported add/drop/rename operations | Compatible schema-on-write and version/engine-dependent add/drop/rename |
| Data processing | Analytics using snapshots and partition pruning | COW/MOR tables, upserts and incremental processing |
| AWS integration | A compatible Iceberg writer and catalog such as Glue | Catalog synchronization matching Hudi/EMR/engine versions |
| Selection criteria | Query, retention, deletion and concurrent-writer requirements | Upsert, compaction, query and recovery requirements |
The minimal path below is a plain Parquet external table. Uploading Parquet and setting a table_type=ICEBERG string do not create Iceberg metadata, manifests, snapshots or ACID commits. If Iceberg is required, add a compatible catalog/writer stage that creates the table and commits append/delete operations. Verify supported schema changes and engine compatibility for either format.
Airflow DAG Example
Place the three modules below on the same Python path. They require the Airflow 3.1 SDK, Amazon provider 9.16, Requests and PyArrow. Exceeding the fixed 100-page/10,000-row bounds, duplicate observations or incomplete pagination fails the export instead of reporting a partial success. The UTC window is [data_interval_start, data_interval_end); ds is not interpreted as “yesterday.” Late-arriving or changed observations require a separate backfill and approval review.
Supply LANGFUSE_BASE_URL (an HTTPS origin), project-scoped public/secret keys, LANGFUSE_PROJECT_ID, APPROVAL_FILE, TRAINING_BUCKET and TRAINING_KMS_KEY_ARN. Inject keys from a secret store. Use workload identity with scoped S3/KMS permissions; the example creates no account, role or bucket.

The sample hash binds the approved redacted content. The daily schedule uses UTC 06:00 boundaries; change the schedule and interval together if reporting needs calendar-midnight windows. Pagination checks validate counts and duplicates, not a consistent point-in-time view of a changing upstream.
AWS Glue Catalog Registration
Pass a completed manifest through a trusted job path before calling this function. An existing Glue database and appropriate permissions are prerequisites. Each snapshot has its own external-table name; the manifest is outside the table's data location. On retry, verify existing table/partition locations, schemas, formats and Serde, plus table type and partition values; mismatches fail for operator reconciliation instead of being overwritten. Partition-registration errors also fail the job. Registration alone implements neither revocation/deletion of stored data nor Iceberg transactions.

Reward Labeler Fleet
Reward Labeling Concept
A 0–1 score is a candidate-selection signal from the chosen rubric and evaluator. A model score guarantees neither factual accuracy nor training benefit. DPO needs chosen/rejected responses to the same prompt, plus leakage/deduplication checks. GRPO needs prompts and reward functions/environments applied to newly generated groups. A single stored scalar score is not either training format.
Approved generation → successful evaluation with finite scores → scored-trace candidate
Missing context/reference, revoked approval or evaluation failure → failed job/restricted rejection record
Scored-trace candidate → separate review, split and conversion → training format
Evaluation Metrics Combination
Ragas Metrics
The Ragas evaluation framework evaluates RAG output against the selected metrics/evaluators. Faithfulness needs response/context; answer relevancy needs question/response and an embedding adapter; reference-based context precision needs question/context and a reviewed reference. Do not fill non-RAG records with empty contexts or substitute the generated answer for a reference.
reward_contract.py validates schema and finite 0–1 scores. The following numbers are illustrative arithmetic inputs, not measured results.

The example selects the official Qwen/Qwen3-4B repository and an explicit revision as one candidate judge. YAML and clients share the qwen3-judge served alias. Calibrate it against reviewed multilingual/domain samples before treating its scores as useful evidence; a small model is not ground truth. The prompt is not a prompt-injection security guarantee. Final Reward Aggregation
The Ragas weights and judge blend are explicit policy inputs. Do not convert NaN, infinity, string/boolean scores, out-of-range values or incomplete responses into zero scores or success. The illustrative blend is 0.6 × 0.894 + 0.4 × 0.85 = 0.8764.
KServe InferenceService Deployment
The manifest proposes KServe Standard mode with KEDA as the external autoscaler. It requires GPU nodes/drivers/device plugins, runtime/model compatibility, the Secret, KServe networking and Prometheus scraping. nvidia.com/gpu: 1 counts devices; memory is host RAM. These settings guarantee no VRAM, KV-cache or concurrency capacity. Pin the image to an approved digest when preparing a deployment.

Autoscaling Strategy:
- Confirm the actual
reward-labeler-qwen3-predictorDeployment, owner and labels before attaching KEDA. Do not run a KServe-owned HPA and KEDA-owned HPA concurrently. Verify the controller-version-specific transition and handling of existing HPAs. vllm:num_requests_waitingcounts queued requests. The query assumes scrape configuration addsnamespace, and sums engine/pod series into one result. This queue-only policy still needs validation of active requests, scale-down draining and latency SLOs.- One to four replicas, threshold 10 and a 300-second scale-down stabilization window are starting settings, not throughput/availability guarantees. Empty Prometheus results are errors with
ignoreNullValues=false. - Set
JUDGE_BASE_URL, including/v1, after verifying the actual Service/route and port. Do not infer a:8000endpoint from the InferenceService name. Configure TLS, authentication and network boundaries for external exposure.
Batch Evaluation Job
Add Ragas/OpenAI/langchain-openai, HTTPX 0.28.1, httpcore 1.0.9 and PyArrow to the modules above. Configure EMBEDDING_BASE_URL, EMBEDDING_MODEL, EMBEDDING_REVISION and EMBEDDING_API_KEY for a separately approved embedding endpoint. A judge-only vLLM server is not assumed to serve embeddings. No Bedrock adapter or billing model is selected implicitly.
The input is the single CANDIDATE_MANIFEST_KEY returned by export. A seven-day dataset requires a separate verified union of approved manifests, intervals and IDs. This example does not scan an entire S3 prefix using fixed dates. Evaluation endpoints receive the selected redacted content and therefore need approved data-transfer and logging/retention policies.
The job bounds concurrent work to four requests with limited retries/timeouts. It checks result counts/order and retains IDs. Any evaluation or renewed-approval failure prevents publication of the scored-dataset manifest; the restricted rejection prefix retains only IDs and a reason code. Record request counts, latency, token usage and failure rates during real execution, and enforce wall-time/cost limits in the job environment.
Approval can expire or be revoked during evaluation. A trusted approval process must replace the file atomically. The DispatchAuthorization helper rereads it for every request and checks every sample in the batch. An unapproved sample or an unreadable file stops that evaluation attempt.
Ragas LLM and embedding calls and the custom judge share this check. It runs after the request queue, immediately before sending headers and the body after connection waiting, and before each body chunk. Both HTTP transports disable connection retries; an SDK retry passes through the check again after backoff. The example relies on HTTP/1.1 trace hooks in HTTPX 0.28.1 and httpcore 1.0.9. Additional adapters, callbacks or HTTP clients must preserve this path.
Ragas 0.3.9 AnswerRelevancy awaits question generation, then calls synchronous embed_query and embed_documents. Both synchronous and asynchronous clients therefore need the check. Each evaluation attempt allows one synchronous request and three asynchronous requests. Separate limits prevent a synchronous call from waiting for a slot held by async work on the same event loop. The synchronous call itself can still block that loop.
Approval checking and sending are separate operations. Approval can change immediately after a check, and a remote approval-store change may not yet appear in the file. Requests or bytes already sent cannot be retracted. Verify the actual adapters and endpoints separately; the offline checks below do not establish successful model calls or deployment.

Cost Example
These prices are hypothetical arithmetic inputs, not provider quotes. Three nodes running ten hours each per day at an assumed $1.00 per node-hour cost 3 × 10 × $1.00 = $30/day, or $10,950/year for 365 identical days. Replace replica counts and operating hours with actual execution records.
Table 2. Cost items, units, and the scope of this example
| Cost item | Unit | Scope in this example |
|---|---|---|
| Self-hosted judge + Ragas LLM | Node-hours across all replicas × the selected purchase-option rate | Do not count the same fleet's compute twice |
| Separate embedding endpoint | Self-hosted compute or model-specific input-token/request units | Use the actual provider/model/contract meter |
| If a separate paid LLM endpoint is selected | Input tokens × input rate + output tokens × output rate, as applicable | A different choice from self-hosting; verify the model/service units |
| S3/KMS, orchestration, network, logs, idle/startup time | Service-specific usage | Excluded from the $30 arithmetic |
Record region, observation date, purchase option (such as Spot/On-Demand), operating hours, model revision, input/output/embedding tokens and retries. A comparison with manual review must use the same quality and work scope. This document contains neither actual execution costs nor a manual-review baseline, so it presents no savings percentage.
